Quantizing Large Language Models Weakens Their Self-Explanations, Study Finds
New research shows that compression techniques used to speed up LLM deployment can degrade the quality and trustworthiness of the explanations these models generate for their own decisions.
A team of researchers has examined how quantization — a common compression technique that reduces the computational demands of deploying large language models — affects the models' ability to explain their own reasoning. The findings, published on arXiv, raise important questions about whether such optimization methods compromise the transparency that increasingly matters for high-stakes applications.
What the Study Found#
Researchers tested how three prevalent quantization methods affected two types of self-generated explanations: natural language descriptions and counterfactual examples. Their results revealed that quantization typically causes moderate but measurable deterioration in explanation quality, with declines reaching up to 4.4%, and a similar drop in how faithfully models justify their outputs (down to 3.9%).
A separate evaluation involving human reviewers showed even more pronounced problems: participants found that quantized models produced explanations that were up to 8.5% less coherent and trustworthy than uncompressed versions.
Why Size Matters#
The study also uncovered asymmetries in how different model scales respond to compression. Larger models retained more fidelity to their reasoning processes when quantized, though they did not show exceptional resilience when it came to the perceived quality of their explanations. Smaller models fared worse overall under quantization.
Broader Implications#
No single quantization technique proved superior when balancing all three measures — task accuracy, explanation quality, and reasoning fidelity. Because the negative effects vary significantly depending on the specific application context and can sometimes be substantial, the researchers recommend that organizations thoroughly test whether explanations remain adequate for their particular use case before deploying quantized models in sensitive domains. Nevertheless, when validated properly, quantization continues to offer practical value as a compression solution.
