Consistency Models Slash Robot Task Inference Speed by 10x Without Sacrificing Accuracy
A new diffusion-based approach uses consistency constraints to enable single-step action generation for real-time robotic manipulation.
Researchers have developed a method to dramatically speed up diffusion models for robotic control tasks. The technique, called ManiCM, achieves tenfold improvements in inference speed while maintaining competitive success rates across dozens of manipulation benchmarks.
The Speed Problem with Diffusion Models#
Diffusion models have proven effective at learning complex behaviors for robotic tasks, from grasping objects to performing multi-step motions. However, these models typically require dozens of denoising iterations to generate each action—a major bottleneck when robots need to respond in real time. This inefficiency becomes especially acute when processing high-dimensional input like point cloud 3D vision data.
A Consistency-Based Solution#
Rather than iteratively refining noisy predictions, ManiCM reformulates the problem using consistency constraints. The model learns to predict robot actions directly from any point along the denoising trajectory, enabling one-step inference. This is achieved through a specialized distillation technique that predicts final action samples rather than intermediate noise predictions—a shift that accelerates convergence in the low-dimensional space where robot actions naturally live.
The approach conditions action generation on point cloud observations, maintaining the spatial reasoning capabilities that make vision-based manipulation possible.
Evaluation and Results#
Testing on 31 standard robotic tasks across the Adroit and Metaworld benchmark suites demonstrates the method's effectiveness. ManiCM delivers approximately 10× faster average inference speed compared to state-of-the-art diffusion baselines while preserving competitive task success rates. This balance makes the approach practical for real-world systems where both speed and accuracy matter.
