Researchers tackle repetitive language generation in AI models with geometric state-space approach
A new technique called Reinforced Mode Regulation uses low-rank damping to prevent large language models from getting stuck in repetitive output patterns during text generation.
Mode collapse—where AI language models fall into repetitive or looping text generation—remains a stubborn challenge in building more capable generative systems. Rather than treating it as a straightforward token-level problem, researchers now view it through a dynamical-systems lens, revealing the deeper geometric forces behind the issue.
The root cause: geometry, not just tokens#
When language models generate text, their internal representations can become confined to low-dimensional regions of the model's state space, even though the full capacity of the system is available. This geometric collapse is what drives mode collapse: the model's trajectory becomes increasingly constrained, leading to repetitive outputs or premature convergence to a single style or topic. Conventional fixes—symbolic constraints or probability-tuning heuristics—cannot reliably prevent this phenomenon because they operate at the wrong level of the problem.
A lightweight intervention approach#
The proposed solution, Reinforced Mode Regulation (RMR), works by intervening directly in the model's internal representation during generation. The technique targets the Transformer's value cache—the stored representations that guide attention patterns—and applies low-rank damping to suppress self-reinforcing directions that drive the geometric collapse. This approach is lightweight enough to run in real time without substantial computational overhead.
Significant improvements in stable, low-entropy generation#
Across multiple large language models, RMR enables stable generation even at extremely low entropy rates (down to 0.8 nats per step), a performance level where standard decoding methods typically collapse near 2.0 nats per step. This suggests the method genuinely addresses the underlying mechanism, rather than papering over symptoms.
