Small LLM Outperforms GPT-4o Using Real-Time Policy Evolution During Reasoning
A new framework lets language models dynamically refine their reasoning strategy by learning from failed attempts during inference, enabling a 4-billion-parameter model to surpass much larger competitors.
Researchers have demonstrated that large language models can dramatically improve their reasoning ability by refining their internal strategy in real time, rather than relying on a fixed approach. The breakthrough, presented in a paper titled Policy of Thoughts (PoT), shows that a compact 4-billion-parameter model can outperform GPT-4o and DeepSeek-V3 on coding benchmarks—despite being more than 50 times smaller—by continually learning from its own mistakes during problem-solving.
The Core Problem#
LLMs typically struggle with complex, multi-step reasoning tasks because they operate under a frozen policy—meaning their reasoning approach stays locked in once the model is deployed. When these models encounter difficult problems, they lack a mechanism to dynamically adjust their strategy based on feedback about what's working or failing.
How Policy of Thoughts Works#
PoT reframes reasoning as an online optimization process that happens within a single problem-solving instance. The approach unfolds in two main stages:
- Exploration: The system generates multiple candidate solutions using an efficient exploration mechanism, creating diverse approaches to the same problem.
- Refinement: It then applies Group Relative Policy Optimization (GRPO) to update a lightweight adapter (LoRA) based on execution feedback from each attempt.
This closed-loop design enables the model to refine its reasoning priorities on the fly, tailoring its strategy to the specific problem at hand rather than applying a one-size-fits-all approach.
Inspiration from Epistemology#
The researchers drew conceptual inspiration from philosopher Karl Popper's theory of "conjectures and refutations," which posits that genuine intelligence emerges through proposing ideas and learning from their failures. Rather than treating feedback as merely a signal to filter or rewrite solutions after the fact, PoT internalizes it to actively reshape how the model reasons.
Dramatic Performance Gains#
Testing on LiveCodeBench, a challenging coding evaluation suite, the 4B model achieved 49.71% accuracy—surpassing both GPT-4o and DeepSeek-V3 despite the massive size disparity. This suggests that adaptive reasoning strategy can partially compensate for raw model scale, at least on certain problem domains.
