Temporal-Logic Causal Diagrams Help Reinforcement Learning Agents Learn Faster
Researchers propose a method to reduce exploration in RL by capturing causal relationships between environmental properties, enabling agents to converge to optimal policies more quickly.
Reinforcement learning agents tasked with meeting long-term objectives often struggle with inefficient exploration—trying countless actions to understand the environment. A new approach aims to reduce this waste by embedding causal knowledge directly into the learning process.
The Problem with Current Approaches#
Researchers typically represent complex, time-extended goals in RL using deterministic finite automata (DFAs), which capture reward structures but ignore why certain environmental changes happen. This gap forces agents to learn through trial and error alone, leading to slower convergence and unnecessary exploration.
Introducing Temporal-Logic-Based Causal Diagrams#
The proposed Temporal-Logic-based Causal Diagram (TL-CD) framework captures how environmental properties causally relate to each other over time. By combining a TL-CD with a task-specific DFA, agents can identify situations early in learning where they can confidently predict expected rewards without exhaustively testing all possibilities.
Benefits Demonstrated#
Case studies show that this hybrid approach yields faster convergence to optimal policies compared to standard RL methods. The key insight: causal structure lets agents reason about consequences rather than brute-force explore them.
